In a Production Retrieval-Augmented Generation (RAG) pipeline, the Vector Database serves as the primary long-term memory for Large Language Models (LLMs). While traditional databases index exact text strings, vector stores index dense numerical representations (embeddings) generated by deep learning models, enabling fast semantic retrieval based on meaning rather than exact keyword matches. When paired with LangChain, vector databases act as the retrieval layer that injects relevant enterprise data directly into the prompt context sent to the LLM. Core Architecture & Flow 1.Ingestion & Indexing: Data (PDFs, docs, HTML) is split into manageable chunks (typically 500–1,000 tokens) using LangChain text splitters. An embedding model (e.g., OpenAI, Cohere, HuggingFace) maps each chunk to a high-dimensional vector and stores it along with original text metadata. Retrieval Strategy: When a user queries the system, LangChain converts the user's string into an embedding vector, performs an Approximate Nearest Neighbor (ANN) search (e.g., Cosine Similarity, HNSW), and extracts the top k relevant chunks. Augmentation: LangChain passes the retrieved text chunks to the LLM context window to generate grounded, hallucination-reduced answers. Key Requirements for Production Vector Databases Unlike local prototypes (like Chroma or FAISS in memory), production-grade vector databases must satisfy critical enterprise constraints: Hybrid Search & Metadata Filtering: Combining vector similarity search with structured SQL/JSON filtering (e.g., filtering by tenant_id, created_date, or category). Distributed Scalability: Horizontal scaling to handle millions or billions of high-dimensional vectors with low query latency (< 50\text{ ms}). Index Maintenance: Support for real-time CRUD operations without locking the database or forcing complete re-indexing. Role-Based Access Control (RBAC): Restricting data visibility at the chunk/vector level according to user roles.
